Description

Neural Network Coding (NNC) is a Rel-19 concept specified in 3GPP TR 26.847 and TR 26.927 that defines how neural network models used in 5G-Advanced and future networks are compressed and encoded for efficient transport and storage. As 3GPP increasingly integrates AI/ML capabilities into the core network, radio access network, and media services, the size of neural network models becomes a critical constraint. A typical deep learning model can range from a few kilobytes to hundreds of megabytes, and transmitting such models over the air interface or between network functions without compression would consume significant bandwidth and introduce latency. NNC addresses this by providing standardized coding tools that reduce model size while preserving inference accuracy.

The architecture of NNC is built around a modular pipeline that separates model representation, transformation, and entropy coding. First, the neural network is expressed in a standardized representation format (see NNR), which captures the topology, layer types, weights, biases, and activation functions in a structured, machine-readable form. Second, NNC applies a series of coding operations such as quantization, pruning, weight clustering, and matrix decomposition to reduce redundancy in the model parameters. Third, an entropy coding stage compresses the transformed parameters using techniques analogous to those used in video and audio codecs, such as arithmetic coding or Huffman coding. The decoder reverses these operations to reconstruct a model that is functionally equivalent or near-equivalent to the original.

Key components of NNC include the encoder, the decoder, and the bitstream syntax. The encoder takes a neural network representation as input and produces a compressed bitstream. The decoder reconstructs the neural network from the bitstream. The bitstream syntax defines the structure of the compressed data, including headers, parameter sets, and payload segments, ensuring interoperability between different vendors and network functions. NNC also supports scalability, allowing a single bitstream to contain multiple quality or complexity layers, so that a receiver with limited computational resources can decode a lower-complexity version of the model.

In the broader network context, NNC plays a crucial role in enabling AI/ML model distribution across the 5G system. For example, a core network function may train a model and distribute it to multiple RAN nodes using NNC-compressed bitstreams. Similarly, a UE may download an updated model for on-device inference. NNC also supports model updates and differential coding, where only the changes between model versions are transmitted, further reducing overhead. This is particularly important in federated learning scenarios, where model updates are exchanged frequently between UEs and servers.

NNC is closely related to other Rel-19 AI/ML enablers such as NNEF (Neural Network Exchange Format) and NNR (Neural Network Representation). Together, these three concepts form a complete framework for representing, exchanging, and coding neural networks in 3GPP systems. While NNC focuses on compression and bitstream syntax, NNEF defines the interchange format, and NNR defines the internal representation. The specifications TR 26.847 and TR 26.927 provide the technical foundations, including use cases, requirements, coding tools, and performance evaluations.

Purpose & Motivation

NNC was created to solve the problem of efficiently transporting and storing neural network models within 3GPP networks. Before Rel-19, 3GPP had no standardized way to compress AI/ML models, which meant that model distribution relied on proprietary or generic compression tools that were not optimized for neural network data. This led to interoperability issues, excessive bandwidth consumption, and high latency in model updates. NNC addresses these limitations by providing a standardized, neural-network-aware compression framework.

The motivation for NNC comes from the growing adoption of AI/ML in 5G-Advanced. Use cases such as network slicing optimization, beam management, positioning, and media processing increasingly rely on neural networks. These models must be distributed to RAN nodes, core network functions, and UEs. Without efficient coding, the overhead of model distribution could outweigh the benefits of AI/ML. NNC enables significant compression ratios, often reducing model size by 10x to 100x with minimal accuracy loss, making AI/ML deployment practical at scale.

Historically, previous approaches to model compression were either application-specific or not standardized. For example, some vendors used proprietary quantization and pruning techniques, while others relied on generic compression formats like ZIP. These approaches lacked interoperability and did not exploit the structural properties of neural networks. NNC builds on decades of 3GPP expertise in media coding (e.g., video, audio, and point cloud compression) and adapts those principles to neural network data, providing a robust, extensible, and standardized solution.
